Danny Ings gave the hosts the lead in Ralph Hasenhuttl's first game in charge, before Henrikh Mkhitaryan's leveller.
Ings then headed past Leno once more, before Mkhitaryan's low strike found its way past Alex McCarthy.
Charlie Austin struck in the closing moments of the game to secure all three points for the hosts.
